Optimizing Sensor Calibration Processes with AI
The micro-electro-mechanical systems (MEMS) industry has witnessed exponential growth and widespread adoption of MEMS-based inertial measurement units (IMUs) across various applications, from consumer products to automotive and military use. These MEMS-based sensors, including accelerometers and gyroscopes, are the essential components that enable modern inertial systems and influence their overall performance.
As demand for inertial sensor accuracy continues to rise, driven by cutting-edge technologies like navigation and positioning, autonomous driving, and personal wearable devices, the challenge of producing high-precision inertial sensors for high-end production remains significant and expensive. MEMS inertial sensors are subject to various deterministic and random errors, such as measurement error, alignment error, quantization noise, and random noise, which accumulate during the production process and impact sensor performance. Consequently, calibration and characterization have become crucial and unavoidable steps in the MEMS manufacturing process to ensure high precision and accuracy of the inertial sensors.
Addressing Inefficiencies in the Sensor Calibration Process
The primary issue with the current calibration procedure for MEMS sensors is the use of a sequential and uniform approach. Calibration requires a set number of predetermined steps for all sensors, and no changes are allowed afterward. Although each sensor experiences the same conditions, it attains distinct operating points due to technological differences between MEMS and application-specific integrated circuit (ASIC) components or the encapsulation process. This results in a time-consuming process that affects the total calibration duration, making the calibration inefficient and prolonged.
To address these issues of inefficiency and longer duration in MEMS-based sensor calibration, this research leverages the potential of Artificial Intelligence (AI) -based solutions. AI-based algorithms, such as different supervised or unsupervised algorithms, have already proven beneficial in industrial applications for data-driven decision-making, predictive analysis, and automation.
The primary objectives of this research are:
- Optimize the calibration process in MEMS-based sensor manufacturing more effectively to reduce the time.
- Create a robust and flexible solution to avoid unforeseeable changes during the manufacturing process.
Proposed Smart Calibration Framework
To achieve these objectives, the researchers present a calibration framework that utilizes different supervised regression-based algorithms to reduce the calibration time with minimal system changes. This framework is then extended to an end-to-end monitoring system to ensure smooth production implementation and operation, even in the face of process changes, data anomalies, or model drift.
The proposed smart calibration framework leverages the potential of machine learning (ML) regression models, such as XGBoost, to predict the correct working point for each sensor, replacing the traditional sequential calibration steps. By utilizing both sensor-level and component-level data (ASIC and MEMS) from previous measurements, the ML model aims to accurately predict the working point, reducing the number of required calibration steps.
The key advantages of the proposed framework include:

- Process Continuity: A fallback step using the traditional process is provided to ensure seamless continuation of the manufacturing process and maintain product quality.
- Cost Saving: By optimizing the calibration process, the proposed method can unlock significant cost savings, as calibration can be an expensive procedure.
Experimental Evaluation and Results
The researchers evaluated the proposed smart calibration framework on a dataset of approximately 2 million records, covering 15 calibration or measurement blocks for MEMS-based closed-loop inertial sensors used in automotive applications.
The results demonstrate that the proposed ML-based solution, utilizing the XGBoost regression algorithm, outperformed other ML models, such as Linear Regression, Ridge Regression, and Polynomial Regression, in terms of key performance metrics like Mean Absolute Error (MAE), Mean Squared Error (MSE), R-squared (R2), and Root Mean Squared Error (RMSE).
Compared to the traditional sequential calibration process, the proposed framework achieved a time reduction of 23.8% for the eight measurement blocks under investigation. For a specific measurement block related to quadrature error compensation, the time consumption was decreased by 48%.
Adaptive Monitoring for Robust Implementation
To ensure a seamless and reliable implementation of the proposed smart calibration framework, the researchers designed an end-to-end monitoring system that incorporates two critical checkpoints:
